一、大模型为什么跨不过工厂的“最后一米”?

虎嗅智库:先划一条边界。大模型在工业管理端已经能写报告、查知识、做培训,为什么一进入设备控制和工艺调整,难度就完全不一样了?

方宁:大模型的优势主要是语义理解和技术推理。因此,在管理端,也就是IT侧,它可以帮助工程师写报告、检索知识、做培训,这些应用相对容易落地。

但一旦进入设备控制、工艺优化、参数调整等OT侧场景,AI面对的就不再是文字和知识,而是一条真实运行的生产线。这里有三道“硬约束”是绕不过去的。

第一是实时性。控制端经常要求毫秒级响应,而大模型目前的推理速度很难跟上设备的运行节拍。生产线不会停下来等模型思考完再动作。

第二是安全性。工业现场对错误几乎是零容忍的。聊天机器人答错一句话可以重新生成,但控制系统做错一个动作,带来的可能是废品、停线,甚至设备和人身事故。大模型在文本场景中的“幻觉”,在生产线上是不能被接受的。

第三是不可观测性。现场采集到的数据,并不是物理世界的全部真相。传感器能看到的只是少数切面,而真正决定工艺结果的变量,可能没有被测到。

虎嗅智库:这是否意味着,大模型只能停留在工厂的管理端,无法进入OT侧?

方宁:不能简单理解为“大模型不能进入OT”,关键是它以什么方式进入。

如果让通用大模型直接输出设备控制指令,风险很高。但如果让它承担知识理解、辅助诊断和技术推理,再由机理模型、优化算法和控制系统负责执行,路径就不同了。

因此,我们在架构上把工业AI拆成两个方向:小数据AI大数据AI

小数据AI是以机理为主、数据为辅。它要吸收资深工程师在工艺诊断、参数调整和设备操作上的经验,再结合传感器反馈、领域知识、优化算法与物理机理模型。

它主要解决的是“两提四节双安全”:提升品质、提升效率;节省成本、能耗、人力和折旧;同时保障人身安全与设备安全。

这条路线的特点是,在同一领域内具有较强的泛化能力。只要第一性原理和关键机理被分析透,就有机会在不同设备和相近场景中进行自适应应用,也能尽量避免大模型的“幻觉”和偏差。

大数据AI则是以数据为主、机理为辅,更偏向IT层和多源数据融合,主要用于全厂级生产调控和跨系统的预测性维护。

两者不是互相替代,而是在不同层级解决不同问题

二、工厂已经采了很多数据,为什么AI还是看不懂?

虎嗅智库:不少工厂已经建设了数据平台,设备数据也在不断上云。为什么这些数据一进入控制层,仍然难以形成安全、可靠的闭环?

方宁:核心原因是,工业现场在数学上属于“部分可观测系统”。

物理系统的真实状态是高维的,也很难被完全穷尽。但传感器采集并传到IT端的数据,只是经过压缩后的少数数值。看起来数据很多,并不意味着它们足以还原现场。

以炉膛温度为例,我们通常通过热电偶测量温度。但热电偶测到的,只是某个位置、某个采样频率下的温区数据。产品在生产线上流动时,它内部或表面的真实温度,可能根本无法直接测量。

再比如反应器中的催化剂活性,它的真实状态也很难直接获取,只能通过外围指标进行估算。

工厂里还有一个常见问题,叫“同参数、不同良率”。在IT系统中,两台机台的控制参数看起来完全一致,但一台良率高,另一台良率低;或者同一台设备之前运行正常,过一段时间后,同样的参数却无法得到同样的结果。

原因在于,传统IT系统看到的往往是均值、极值或经过压缩的数据。那些真正决定物理状态变化的底层控制特征,可能在上传过程中已经丢失。

所以,AI的难点不一定是数据太少,而是关键数据常常根本不存在,或者以错误的形式存在。

虎嗅智库:也就是说,工厂数据平台上的“参数一致”,并不代表设备在物理世界里的状态一致?

方宁:对。工业控制在数据层面会遇到三层挑战:

第一层是,可观测数据如何影响结果。例如,不同参数设置、不同人员操作,分别造成了怎样的结果差异。这一层,大多数IT工程师和工艺工程师可以通过关联模型来分析。

第二层是,数据看起来一致,结果却不一致。同一套控制方案之前有效,过一段时间后失效;或者系统显示两台机台参数完全相同,良率却相差很大。这通常意味着,现有数据没有反映物理世界的真实变化。

第三层更难,如何找到未被观测的数据,以及如何处理从未出现过的即时问题。

传统机器学习模型的能力边界,往往由训练数据集决定。但工业现场的突发问题经常会突破这个边界。如果模型从未见过类似状态,仅靠历史数据进行外推,就很容易失效。

虎嗅智库:那问题就变成了——既然关键变量测不到,AI究竟该依据什么做判断?

方宁:这正是工业AI必须引入机理、专家经验和因果分析的原因。不能只问“哪些数据和结果同时出现”,还要继续追问:设备为什么变成这个状态?哪个变量真正推动了结果变化?如果改变某个控制动作,结果会发生多大变化?

这也是我们强调从控制底座向上构建AI能力的原因。

三、从“相关”走向“因果”,能解决什么问题?

虎嗅智库:“相关性”和“因果性”听起来比较学术。放到工厂里,两者到底差在哪里?

方宁:可以用一个经典例子来理解。

统计数据可能显示:一场火灾中,出动的消防员越多,最终造成的经济损失往往越大。如果只看相关性,模型可能得出一个荒谬结论——少派消防员,就能减少损失。

但因果分析会继续追问:真正同时影响消防员数量和经济损失的变量是什么?答案是火灾规模。火灾越大,需要的消防员越多,造成的损失也越大。消防员数量和经济损失都是结果,火灾规模才是背后的关键原因。

工业现场也一样。模型不能因为某个参数与良率同时变化,就认定调整这个参数一定能提升良率。我们需要判断谁是因、谁是果,以及改变某个变量后,结果究竟会发生多大变化。

问题在于,我们无法让同一台设备在同一时间既执行某项调节,又不执行这项调节,再对两个结果进行直接比较。因此,传统统计方法往往只能基于不同样本“拉平均”,但工业控制真正需要的是对干预结果进行量化。

虎嗅智库:那么,因果推断具体如何进入设备控制?

方宁:因果推断通常可以分为三个层次:观察、干预和反事实

观察是看到了什么,传统深度学习主要擅长这一层;干预是主动调整参数,观察系统如何变化;反事实则进一步追问,如果当时没有做这个动作,结果会不会不同。

在工业应用中,我们重点关注两个框架。

一个是Judea Pearl提出的结构因果模型,即SCM。它主要解决变量之间“谁是因、谁是果”的因果图谱问题。

另一个是Donald Rubin提出的潜在结果模型,即POM。它关注的是:某个原因发生变化后,具体能够带来多大的结果变化。

方宁:时序大模型更擅长预测连续过程的演化趋势。对于连续不间断、涉及物理化学变化的流程工业,这类模型比较适用。

但中国有大量工厂属于离散制造。离散制造是围绕工单、事件、领料批次和加工周期运行的,具有明显的周期性。生产规格一变,运行参数也会频繁地被人为调整。

这意味着,离散制造不能只沿着时间线向后预测。模型还要理解:这次参数变化是设备状态造成的,还是因为更换了工单?良率波动来自原材料批次,还是来自操作方式?系统当前看到的观测值,究竟能不能反映真实状态?

因此,离散制造不仅要用时序预测“接下来会发生什么”,还要用因果关系解释“为什么发生、改变哪个变量才有效”。基于这一思路,我们推出了时因大模型。

虎嗅智库:技术路线讲清楚之后,下一步就是落地。在具体的工业场景中是如何分类落地的?

方宁:我们认为,工业AI的案例不应该按行业平铺罗列,这样很容易变成项目清单,且看不出方案能否复制

工业AI更应该按照问题类型进行分类:现场究竟是测不到真实变量,还是控制动作和工艺结果脱节?只有先识别问题类型,才能选择相应的模型、算法和控制方案,并在落地前算清楚商业回报。

比如真实变量测不到的问题。

代表场景包括纺织染整温控、硅片热处理炉膛温度。

这类场景的共同问题是:真正需要控制的变量无法被直接测量,而且系统存在明显迟滞。

例如在烘箱中,传统控制对象往往是箱体内的空气温度,但企业真正关心的是布匹或硅片表面的实际温度。由于系统响应存在8至10分钟的迟滞,人工通常会凭经验把温度设得更高,以确保产品“热透”。但这样很容易造成温度超调和能量浪费。

我们的解决思路是引入软测量与物理神经网络。通过热电偶网络和高温红外探测仪的数据流,模型逆向逼近并预测产品表面的真实温度,再结合即时寻优算法,动态调整各节烘箱的车速和温度输出。

这里最关键的变化,不只是增加了一个模型,而是改变了控制对象:从控制“箱体空气温度”,转向控制“布匹或硅片表面的真实温度”。

虎嗅智库:换句话说,AI首先要解决的不是“如何控得更准”,而是“究竟应该控制什么”?

方宁:是的。如果控制变量选错了,后面的算法再精确,也只是在更精确地控制一个不能代表真实工艺结果的指标。

五、技术能跑通,为什么仍然难以复制?

虎嗅智库:整体听下来这套方案非常硬核,在实际落地过程的难点、痛点在哪里?哪里可能会慢,哪里可能会失败?

方宁:坦诚地讲,工业AI这套路线绝对不是纯软件生意,更不是弄个通用大模型就能即插即用的。它跟底层的设备、核心工艺、控制系统以及现场极其繁重的工程实施是死死绑在一起的。这也意味着,它天然就比那种纯软件AI难推得多,也很难做到爆发式的快速复制。

实际推的时候,痛点非常现实:

首先是因果推断还在工程化早期,很多算法在离散制造里也还在试错,远谈不上成熟。

其次是极其吃“老师傅”经验。模型能跑起来,前提是有懂工艺的人把机理讲透;光扔给AI一堆控制数据,一点用都没有。

再一个是老产线的坑太深。设备协议不通、传感器不够、数据质量差,光是搞定这些前期改造成本就高得离谱,直接拖慢进度。况且跨行业复制基本等于重新来过。锂电的那套东西是无法放到纺织上,每进一个行业都要重新啃一块硬骨头,复制成本根本下不来。

最核心的硬伤,还是在项目制和产品化的冲突上。现在基本是靠专家带着团队去现场帮客户硬啃。如果不能把这些重度的现场经验变成标准化的产品和工具,规模化就无从谈起。

虎嗅智库:这是否意味着,工业AI的护城河和天花板其实来自同一个地方——行业知识越深,能力越难替代,但复制也越慢?

方宁:可以这样理解。工业AI未来是模型公司、工业软件公司、自动化公司和客户工艺团队之间的重新分工。

工业AI的规模复制,绝对不是把一个现成的模型简单复制到十个工厂,而是要把“底层数据诊断—动态因果剖析—控制算法重构—边缘低成本部署”这套方法论和工具链实现产品化。

目前来看,数据诊断和边缘部署环节可以逐步自动化,但中间的核心因果剖析与工艺重构,依然高度依赖专家团队。复制的快慢,取决于该行业的标准化程度,这也是整个工业AI界需要共同攻克的技术断层。
